Due to the fact that I have oil around the dipstick, I concluded that the leak must be coming from that top part - the part that the solenoid and oil valve connect to. I bit the bullet and removed it. Three bolts - two on the bottom, and the top one that holds the solenoid on.

Warm water + soap + pump (pressurize) and then spray around with engine hot. I keep the spray pointed instead of wide. Repeat one more gallon if needed.
